It's true, but God didn't actually explain why when He gave the commandment.
Most likely it's because tea contains various harmful chemicals (notably caffeine and tannin). It has a lot of antioxidants, too, but apparently they don't compensate - and you can get antioxidants from plenty of other foods and drinks.
Herbal teas are fine; they aren't really teas at all, they involve completely different plants.
Mormons adhere to a code of health called the Word of Wisdom. Part of the Word of Wisdom includes abstaining from teas made from the Camellia sinensis plant. This includes such varieties as white tea, green tea, black tea and oolong tea. This prohibition includes these teas whether they are served hot or cold.
The prohibition does not include herbal teas.
Section 89 of the Doctrine and Covenants state that we are to abstain from the use of "hot drinks." This has been interpreted to specifically refer to coffee and green tea. Why we are to abstain from these drinks has never really been explained. It's not necessarily the caffeine that is the reason for this prohibition because we are also told to stay away for decaffeinated coffee, but we are permitted to drink caffeinated sodas.
Does anyone know EXACTLY who it was that interpreted "hot drinks" to mean coffee and tea?

Where did you learn that herbal teas are okay? I’ve heard this many times, but I’ve never found anything from the Church to support it.

I don't think that the Church does have an official statement; I haven't heard of one. But I learned from Wikipedia that herbal teas aren't actually teas, because they aren't made from the tea plant (Camellia sinensis). They're better described as 'infusions' or 'tisanes', and they're usually made from various flowers. So, there's no actual reason to consider them 'tea', except that they're drinks produced by putting a plant in water.
